BB bearing shields keep falling out when I pull the cranks

Back story:
Whenever I pack my S&S-coupled travel bike I need to remove the crankset from the frame to get the thing to fit in the 26"x26" S&S case.
For the first 8 years that I owned this bike I had a Shimano Ultegra groupset (6700). Pulling and reinstalling the cranks was a no-brainer, perfectly routine, nothing ever went amiss.
A year ago I upgraded the 10-sp Ultegra shifters & derailleurs to 11-sp SRAM eTap, and also changed the cranks & bottom bracket to SRAM Force.
Now whenever I remove the crankset the bottom bracket bearing shields fall off!

Is this normal?
If so, is there anything I need to do other than just pop them back on (in?)
If not, is there something I should be doing to prevent this from happening?

Related question: If I want to replace the bottom bracket bearings, is it possible to just install new cartridge bearings without replacing the whole GXP BB?

It is normal for the non drive bearing shield with the spline pattern to fall off, because there is nothing holding it to the bearing. The drive side is a plastic piece that snaps into the drive side bearing, but it can become stuck to the spindle and pull out with the spindle.

The bearings are removable from the GXP bottom bracket, but I don't think they are a standard size that you would be able to find for purchase. The complete bottom bracket is fairly inexpensive to replace.
